Observability

FastMCP 2.0 lacked observability for tool execution metrics, email workflows, and vLLM integration. Implemented Prometheus-Grafana monitoring stack with custom middleware to track key metrics across the 7-layer architecture.

Issue

The FastMCP 2.0 production system lacked observability into critical operational metrics, including:

  • Tool execution success/failure rates and durations.
  • Email workflow performance and quality ratings.
  • vLLM integration health, such as call duration and success rate.
  • Middleware operations, including deduplication, authentication, and rate-limiting.

This lack of observability required manual log analysis for troubleshooting, with no historical trend data or quantitative tracking of system performance.

Culprit

The architecture had three primary gaps:

  1. Missing Metrics Collection Layer: No Prometheus instrumentation existed within the 7-layer middleware stack.
  2. Unstructured Logging: Error and timing data were embedded in JSON logs without quantitative tracking.
  3. No Visualization Pipeline: While raw metrics could theoretically be collected, there was no integration with Grafana or dashboarding for visualization.

The middleware stack processed all requests but only emitted unstructured logs without quantitative tracking, making it difficult to monitor performance and identify issues proactively.

Solution

Prometheus Middleware Integration

A custom Prometheus middleware was developed to collect 15 key metrics, including:

  • Tool execution success and failure rates.
  • Execution durations for tools and vLLM operations.

This middleware was integrated into the existing middleware stack, ensuring that each layer of the system could be monitored for performance and errors.

7-Layer Instrumentation

The middleware stack was updated to include Prometheus middleware as the first layer, followed by existing middleware components such as:

  • Email deduplication middleware.
  • Email authentication middleware.
  • Rate-limiting middleware.
  • Error handling middleware.
  • Timing middleware.
  • Structured logging middleware.

FastAPI Metrics Endpoint

A Prometheus metrics endpoint was added to the FastAPI application, enabling Prometheus to scrape metrics data from the system. This endpoint was mounted at /metrics in the application, allowing Prometheus to collect metrics at a specified interval.

Grafana Dashboard Configuration

A Grafana dashboard was configured to visualize the collected metrics. The dashboard included 11 panels, covering:

  • Tool performance: Call rates and duration percentiles (p50/p95).
  • Quality metrics: Rating distribution pie charts.
  • vLLM health: Operation duration histograms.
  • Error tracking: Stacked error rates by type and tool.

The dashboard was configured for auto-refresh every 30 seconds to ensure real-time monitoring of system performance.

Deployment Architecture

The monitoring system was integrated into the deployment architecture, where FastMCP 2.0 collects metrics and forwards them to Prometheus for storage and querying. Prometheus, in turn, provides data to Grafana for visualization.

Key Implementation Details:

  • Scrape Interval: 15 seconds.
  • Metrics Retention: 30 days.
  • Dashboard Auto-Refresh: 30 seconds.
  • Middleware Overhead: Less than 1ms per request.
  • Memory Impact: Approximately 10MB for metrics storage.

Verification Queries:

  • Tool Error Rate:

    sum(rate(fastmcp_tool_calls_total{status="error"}[5m]))
      / sum(rate(fastmcp_tool_calls_total[5m]))
  • vLLM p95 Duration:

    histogram_quantile(0.95,
      sum(rate(fastmcp_vllm_duration_seconds_bucket[5m]))
      by (operation, le)
    )

This solution ensures comprehensive observability across the FastMCP system, enabling proactive monitoring, issue identification, and performance optimization.
